Abstract

With growing pressure from the International Maritime Organization (IMO) to reach net-zero emissions by 2050, accurate prediction of ship Fuel Oil Consumption (FOC) has become increasingly important. Although numerous deep learning-based FOC prediction models have been proposed, studies targeting twin-screw ships remain scarce. In this paper, we propose a dual-branch deep learning architecture for multi-step FOC prediction of twin-screw ships, designed to capture the distinct operational characteristics of the port and starboard propulsion shafts. Each branch independently encodes feature-axis relationships using a Multi-Layer Perceptron (MLP) encoder and temporal patterns using a Gated Recurrent Unit (GRU) encoder. A Squeeze-and-Excitation (SE) block is employed to adaptively fuse the encoded representations, and an autoregressive GRU decoder then generates multi-step FOC predictions. The model is trained on five months of operational data from a RO-RO passenger ship navigating the Gunsan–Shidao route, supplemented with wave data from the Copernicus Marine Environment Monitoring Service (CMEMS). Experiments under various prediction conditions demonstrate that the proposed model consistently outperforms nine baseline models, including LSTM, GRU, transformer variants, and recent hybrid architectures, across the RMSE, MAE, and MAPE metrics.

Lee et al. (2021)은 데이터 특성에 따라 deep feed-forward neural network(DFN) 구조를 변경한 모델을 제안하였고, Chen et al. (2024)는 ensemble empirical model decomposition(EEMD) 방법과 long short-term memory(LSTM)을 결합한 EEMD-LSTM 모델을 활용한 단기 다단계 예측 모델을 구축하였다.

Roll on–Roll off(RO-RO) 여객선이다.

Fig. 5

Structure of TimeSeriesSplit cross validation

z=x-μσ(1)

Relative wind angle=  Wind angle-Heading mod 360 ∘(2)
Relative wind angle=  Swell wave direction-Heading mod 360 ∘(3)

2.4 Encoder

Multi-layer perceptron(MLP)는 Fig. 6과 같이 input layer(입력층), 하나 이상의 hidden layer(은닉층), output layer(출력층)으로 구성된 fully-connected(완전연결) 형태이다.

Fig. 6

Structure of MLP

zt=σWzht-1,xt+bz(4)
rt=σWrht-1,xt+br(5)
ht~=tanhWhrtht-1,xt(6)
ht=1-ztht-1+ztht~(7)
ot=σ0W0ht+b0(8)

2.5 SE block & decoder

Fig. 7

Structure of SE block

z=meanaU(9)
g=αW2ReLUW1z+b1+b2(10)
U′=U⊙g(11)

c=flattenU^∈RH×n(12)
h0=tanhWpc+bp(13)
x0^=wcTc+bc(14)

RMSEy,y^=1n∑i=1n yi-yi^2(15)
MAEy,y^=1n∑i=1n yi-yi^(16)
MAPEy,y^=100%n∑i=1n yi-yi^yi(17)

RNN 및 MLP 계열의 LSTM(Hochreiter and Schmidhuber, 1997), GRU(Cho et al., 2014), TSMixer(Chen et al., 2023), 연료 소모량 예측 분야의 최신 모델인 TCFFA- GRU-Parallel(Hao et al., 2025)과 TSBG-Para(Song et al., 2025), transformer 계열의 transformer(Vaswani et al., 2017), informer(Zhou et al., 2021), reformer(Kitaev et al., 2020)와 convolutional neural network(CNN) 계열의 temporal convolutional network(TCN)(Bai et al., 2018)을 포함하였다.

Overall performance comparison across all input-output length settings(input:10~40min, output: 20min)

Overall performance comparison across all input-output length settings(input:10~40min, output: 30min)

Overall performance comparison across all input-output length(baseline: GRU)

Fig. 8

Overall MAE comparison across all models by input sequence length
